What Is Synthetic Data?

Synthetic data is artificially generated data—not data collected entirely from the real world. It can be designed to imitate useful patterns, create missing examples, or test a system under controlled conditions.

What is it?

Synthetic Data = artificially generated data that is created for a purpose.

The word “synthetic” does not automatically mean “fake” or “bad.” It means the data was produced by rules, simulation, or an AI model rather than being directly observed in the real world.

STARTING POINTReal Data
GENERATION METHODRules · Simulation · AI Model
OUTPUTSynthetic Data
01Synthetic DataGenerated examples are collected into a usable dataset.
02TrainingTeach or adapt a model with additional examples.
03Evaluation / TestingCheck behavior across cases that are safe and repeatable.

Think of it like...

A flight simulator creates realistic practice situations without putting a real passenger flight at risk.

Synthetic data works similarly: a team can create controlled examples—such as rare failures, edge cases, or private-looking records—for practice and testing without waiting for those exact events to happen in production.

How synthetic data is made

The generation method determines what the data can represent and what quality checks are needed.

1 · GoalDefine the useTraining, evaluation, testing, or privacy support.
2 · PatternsChoose a sourceReal data, business rules, a simulator, or a model.
3 · GenerateCreate examplesProduce records, questions, answers, images, or events.
4 · FilterCheck qualityRemove duplicates, unsafe outputs, and obvious errors.
5 · ValidateUse with evidenceCompare against real-world needs before relying on it.

AI example · 100,000 questions and answers

A large model can generate a structured practice set, then a team can review and filter it before use.

100,000 Questionscustomer support · policy · product tasks
+generated by rules, templates, or a larger AI model
100,000 Answerspaired responses with an intended format or behavior
TRAIN A SMALL MODELTeach a narrower model useful patterns.
FINE-TUNINGAdapt behavior with focused examples.
EVALUATIONMeasure answers against a repeatable set.
AGENT TESTINGExercise tools, workflows, and edge cases.

The generated set still needs review. More examples do not automatically mean better examples.

Why teams use synthetic data

Scalable

Generate many examples quickly when real examples are limited.

Cheap

Reduce the cost of collecting and labeling every example by hand.

Controlled

Target rare cases, formats, languages, or scenarios on purpose.

Privacy-friendly*

In some cases, use generated records instead of exposing sensitive real records.

*Privacy-friendly is not guaranteed. Synthetic records can still reproduce sensitive patterns or reveal information if generation and validation are weak.

Risks and failure modes

Bias

Generated examples may repeat or amplify the source model’s blind spots.

Hallucination

The generator may create confident but incorrect questions, facts, or answers.

Low diversity

Many examples can look different while representing the same narrow pattern.

Model collapse

Repeated training on model-generated data can reduce useful variation over time.

Quality loss

Bad data can teach, test, or reward the wrong behavior.

Bad Data → Bad Model. Synthetic data is a production input, not a shortcut around data quality.
CHECK SOURCEWhat real pattern, rule, or model produced this?
CHECK COVERAGEWhich users, cases, languages, and failures are missing?
CHECK AGAINST REALITYDoes performance transfer to real-world data and decisions?

Synthetic Data vs Real Data

DimensionReal dataSynthetic data
OriginObserved or collected from the real world.Generated by rules, simulation, or an AI model.
StrengthShows real behavior and unexpected cases. Can scale and target cases that are rare or hard to collect.
Trade-offMay be expensive, private, incomplete, or difficult to label.May be biased, repetitive, incorrect, or unlike real usage.
Best practiceProtect privacy and check representativeness.Validate quality and compare important results with real data.

What it is NOT

Synthetic Data ≠ Random Noise

Useful synthetic data is generated with a purpose and should represent meaningful patterns.

Synthetic Data ≠ Automatically Private

Privacy depends on how it was generated, checked, and used.

Synthetic Data ≠ Automatically High Quality

Scale can make a weak dataset look convincing without making it correct.

Synthetic Data ≠ A Replacement for Every Real Example

Real data remains important for grounding and validating assumptions.

Remember this

Synthetic data can make AI work more scalable, affordable, controlled, and privacy-friendly in some cases—but only when its quality and real-world fit are checked.
